That rumor started because the original pitch for Gumball was too depressing. Cartoon Network didn't think it was a good fit for the network, so he tweaked it and they approved it.
Some edge-lords just thought it had to have been an [Adult Swim] pitch. There was never any cussing or violence. It was just... sad. It was about a remedial school for rejected characters.
